While I agree with the underlying sentiment here, I don't believe that this is literally true. Some people will be able to outperform you at certain things even if they're doing it for the very first time. For example, if the sport is "poking your head through the smallest possible hole in the wall," then almost any toddler will beat you soundly, no matter how much you train. In this example, the overriding significance of the physical difference between you and the toddler is obvious, but it would be naive to think that physical differences in other sports can always be overcome by training.

But as I said, I agree that people in general tend to underestimate how much difference training can make.
